How to build an Agentic RAG system: an engineering blueprint

Most introductory RAG tutorials use a linear chain: `prompt -> embed -> search -> generate`. This works well for toy demonstrations, but real users do not interact in linear sequences. They submit ambiguous prompts, ask multi-part comparative questions, and frequently ask for information that does not exist in your database.

In a linear chain, any failure at the retrieval step guarantees a failure at the generation step. The system has no ability to pause, evaluate its own progress, rephrase the search query, or consult alternative tools.

Agentic RAG models the retrieval process as a state machine (a directed cyclic graph). Nodes represent distinct computational steps (Planning, Routing, Searching, Grading, Synthesizing), and edges represent conditional transitions based on intermediate evaluation scores.

A robust agentic retrieval system requires five core architectural nodes working together in a stateful loop.

• 1. Intent Router Node: Inspects the incoming user query. Decides whether the question needs document retrieval, structured SQL queries, code execution, or can be answered directly from the base model.
• 2. Query Decomposition Node: If the query is complex or multi-faceted ("Compare our refund policy against European consumer law"), the planner decomposes it into distinct atomic sub-queries.
• 3. Tool Execution Node: Dispatches queries in parallel to the appropriate retrieval backends (pgvector, Elasticsearch, Google Search API, or an internal MCP server).
• 4. Document Grader Node: A fast evaluator reviews the retrieved chunks and assigns a binary relevance grade: does this chunk contain facts relevant to the sub-query?
• 5. Synthesis & Hallucination Guard Node: Generates the answer strictly using graded chunks. A reflection check verifies that all generated assertions are explicitly grounded in the source text.

Because Agentic RAG uses cyclic loops — allowing the system to retry retrieval if initial chunks are poor — engineering safeguards against infinite loops is mandatory.

If a user asks about a topic completely absent from your database ("What is our policy on personal hovercrafts?"), an unconstrained agent might rephrase the query, search again, fail, rephrase, and loop forever, burning thousands of API tokens and leaving the user waiting indefinitely.

To prevent runaways, maintain a strict `iteration_count` variable in the agent state. Enforce a maximum retry budget (typically 2 or 3 attempts). If the grader rejects the chunks after the retry limit is reached, the state machine forcibly transitions to a polite fallback node: "I searched our documentation for hovercraft policies, but could not find any relevant guidelines."

Agentic RAG provides superior accuracy, but multi-step loops introduce latency. An unoptimized agent taking 5 sequential LLM calls can take 6 to 8 seconds to respond.

To achieve sub-2-second response times in production: use small, fast models (like 8B parameter models or lightweight cloud tiers) for the Router and Grader nodes. Reserve the large, expensive frontier model strictly for the final answer synthesis.

Furthermore, cache intermediate routing decisions: common user queries can bypass the planning and grading nodes entirely, executing pre-compiled retrieval graphs.

• Enforce strict maximum recursion depths to prevent runaway token spend
